This study investigates sparse representation， non-convex optimization， and point-sets registration. First， the registered residuals are represented by mixed regularization to establish a sparse mixture formula. The alternating direction of multiplier method （ADMM） is then integrated to solve the proposed formula using a nested framework. Among the variables， the balance weight θ for mixed regularization can be calculated using a sigmoid function. The scalar version is also provided to represent the corresponding loss of function in the inner loop of ADMM. Finally， the soft threshold formula for the scalar version can be deduced in point-set registration. Experimental results indicate that the registration accuracy of the proposed SM-ICP method is better than the that of established algorithms investigated for comparison. This improved accuracy is especially striking in the registration experiment of the Stanford bunny dataset. With 50% overlap rate， the trimmed registration error of SM-ICP was 2.04×10 - 4 . Compared with other methods， our trimmed error was one order of magnitude lower than those of the robust Trimmed-ICP （robust Tr-ICP） and ICP algorithms. Moreover， it was approximately three times lower than the error obtained using the sparse ICP （S-ICP） algorithm. In the registration experiments for both other objects and for scene data， the registration accuracy of the SM-ICP method also performed better than comparable algorithms. In the registration experiment of point-sets with different levels of random noise， the trimmed registration error of SM-ICP was 4.90×10 - 6 ~1.33×10 - 4 . This was several times to one order of magnitude lower than those of other algorithms. In the registration experiment for the engine blade， our method successfully achieved accurate registration of point-sets， but the results produced by comparable algorithms displayed different degrees of dislocation in their point-sets registration. 随着传感器技术的发展，三维激光扫描仪可通过点云感知实体的完整几何信息，在现代工业中占据了重要地位。然而，受遮挡、扫描位姿等因素影响，多视角点云数据在同一坐标下通常是错位且部分重叠的。因此，为了获取完整的三维点云模型，点云配准 ［ 1 1 ］ 旨在搜索相邻视角点云的正确匹配点对，并求解对应的空间变换矩阵。在此基础上，点云配准可将源点云和目标点云配准到相同坐标系下，广泛应用于机器人制造 ［ 2 2 ］ ，空间重构 ［ 3 3 ］ 和医学诊断 ［ 4 4 ］ 等领域。 早在1992年，Besl等 ［ 5 5 ］ 提出的ICP算法就已被认为是强有力的点云配准方法，其原理简单但富有成效，可简单概括为：迭代匹配最近邻点，并同时更新对应的空间变换矩阵，直到收敛。然而，在部分重叠点云配准中，离群值通常指待配准点云的非重叠部分点集，其由于缺乏有效的匹配点对，会使点云配准问题转化成为更具挑战性的非凸优化问题 ［ 6 6 ］ ，以至于ICP算法在该类配准中容易陷入局部最优解。 针对离群值问题，为了提高点云配准的稳健性，在经典ICP算法的基础上，学者提出了一系列的ICP变种方法。其中，Chetverikov等 ［ 7 7 - 8 8 7-8 ］ 提出了Tr-ICP算法，通过计算迭代过程中的最近邻匹配点对的欧式距离，并利用截断最小二乘技术惩罚离群值，可有效实现多视角点云配准，但其难以自主调整截断能量函数的内参。 在多视角点云配准任务中，离群值、噪声是现有配准方法面临的主要问题之一。因此，为了验证本文所提出SM-ICP算法的鲁棒性，设计了不同重叠率的斯坦福兔子点云配准实验。同时，设计了其它类型及存在噪声的部分重叠点云配准实验。为了验证SM-ICP算法的泛化性，还设计了重叠率较高的发动机叶片点云配准实验。在必要的预设参数中，包括ICP ［ 5 5 ］ 在内的四种对比算法中S-ICP ［ 6 6 ］ 和Robust Tr-ICP ［ 8 8 ］ 的范数和能量函数内参分别选择其论文中所推荐的 p =0.4和inlier=2；SM-ICP算法中的范数，则设置为 p =0.1；权重计算中涉及的缩放因子设置为 v =0.9；全部对比算法的停止阈值都设置为0.000 1；评价误差为截断均方根误差，即对配准结果最近邻匹配点对的欧式距离从小到大排序后，只截取和重叠率相同比率的点云均方根配准误差： <math R2017b完成。 4.1　斯坦福兔子点云配准实验 2 首先，利用实际扫描的斯坦福数据集设计了四组不同重叠率的配准实验，分别为第一组（Bun180和Bun90，约50%重叠）、第二组（Bun315和Bun270，约60%重叠）、第三组（Bun180和Top2，约75%重叠）和第四组（Bun000和Bun045，约90%重叠）。首先，对四种点云数据的源点云进行下采样，得到数量为1 800~2 300的采样点。在此基础上，利用四种对比算法求解下采样点向目标点云进行配准的空间变换矩阵，以实现源点云（蓝色）和目标点云（红色）配准。其中，点云初始位姿及对应的配准结果如 图6 图6 所示，可知本文所提出的SM-ICP算法在点云初始位姿较差的情况下，能100%成功地实现了四组不同重叠率的点云精确配准，而其它对比方法或多或少的出现了配准失败的情况。 特别的，在重叠率较低（Bun180和Bun90，约为50%）的配准任务中，除了本文方法以外，其它对比算法的配准结果出现了较为明显的点云错位现象，其中本文方法的配准误差为2.04×10 - 4 m，较Robust Tr-ICP算法和ICP算法减小了一个量级，较S-ICP算法减小了三倍。在点云配准效率方面，本文方法虽然较其它对比算法的配准精度较高，但是由于涉及了更复杂的双循环优化结构，可能较为耗时。然而，SM-ICP算法的平均配准时间仅为2.97 s，具体截断配准误差、配准时间如 表1 表1 和 图7 图7 所示。 2 2 Methods 4 Overlap rate 50% 60% 75% 90% 2 为了进一步测试各算法的点云配准时间，本文以Bun000和Bun045的配准任务为例，对源点云Bun000进行了不同层级的下采样，并通过各对比算法令该下采样点向目标点云Bun045配准，得到对应的配准时间和精度。由 图8 图8 可知，随着下采样点数的增加，本文提出的SM-ICP算法的点云配准时间逐渐增加且高于其它对比算法。然而，SM-ICP算法在源点云的下采样点为12 000的配准任务中，其配准时间仅为8.53 s。而且，当源点云的下采样点较少时，SM-ICP算法不仅配准时间更少，其同样能实现良好的点云配准精度，具体的截断配准误差和时间如 表2 表2 所示。最后，为了更准确的描述配准结果，本文分别计算了各对比算法在Bun180和Bun90配准实验中所得结果最近邻匹配点的欧式距离，并构建了距离直方图，如 图9 图9 所示。本文方法约有一半的最近邻匹配点对距离小于0.01 m，较稳健Tr-ICP多了约45%，较S-ICP多了约30%，较ICP多了约40%，明显优于其它对比算法。本文算法在效率上虽然稍差于对比方法，但其始终保持了良好的精度和鲁棒性。 2 2 Method 6 The number of down-sampled points 2 000 4 000 6 000 8 000 1 0000 12 为了验证本文所提出SM-ICP的鲁棒性，本文还设计了其它类型及存在噪声的点云配准实验。其中，对于其他类型的点云配准实验，Buddha（重叠率约90%）和Dragon（重叠率约50%）来源于斯坦福数据集，而Coati（重叠率约90%）和Stage（重叠率约60%）分别来自算法4PCS ［ 19 19 ］ 和Super4PCS ［ 20 20 ］ 。在此基础上，本文分别对其源点云（蓝色）进行下采样，得到数量为1 300~1 900的数据点，并利用SM-ICP算法求解该数据点向目标点云（红色）配准的空间变换矩阵，实现部分重叠点云配准。其中，SM-ICP的配准结果及点云的初始位姿，如 图10 图10 所示。可以看出，SM-ICP算法不仅适用于其它类型实体的多视角点云配准任务，而且对场景点云（Stage）配准任务同样具有良好的表现。 具体的，与其它算法进行比较，本文分别计算了同等条件下各对比算法应用于 图10 图10 配准任务的截断误差和配准时间，如 表3 表3 所示。其中，SM-ICP应用于点云配准任务的全部截断误差均小于1.93×10 - 5 m，优于或等价于Robust Tr-ICP， S-ICP和ICP三种对比算法。虽然SM-ICP的配准时间需要几秒，稍长于其它对比算法，但是其配准精度，除了在Buddha配准任务中等价于Robust Tr-ICP算法外，均优于其它对比算法，较S-ICP算法和ICP算法提升了1~3个量级。而且，在场景Stage点云配准实验中，SM-ICP的配准时间仅为1.33 s，配准误差为9.451.93×10 - 6 m，较Robust -4 7.69×10 -3 1.14×10 -4 另一方面，为了进一步验证SM-ICP算法的鲁棒性，本文以Coati点云配准任务为例，利用MATLAB中的lhsdesign函数，分别对源点云和目标点云添加具有均匀性、随机性的随机噪声点。在此基础上，本文分别对源点云进行下采样，得到数量为1 500~12 000的下采样点，测试了本文提出的SM-ICP算法在具有不同层级噪声（ N =1 000~5 000）点云配准任务中的性能，如 图11 图11 所示。可以看出，当点云的外围空间存在噪声点时，最近邻点的搜索会受到影响，使得点云配准任务更具挑战性。然而，SM-ICP算法依然能成功地完成全部点云配准任务，表明其具有良好的鲁棒性。 与其它算法进行比较，本文计算了同等条件下各对比算法的配准时间和截断误差，如 表4 表4 和 图12 图12 所示。可以看出，本文提出的SM-ICP算法在不同层级随机噪声配准实验中，其截断误差始终优于其它对比算法。其中，一直表现较优的Robust Tr-ICP算法在源点云和目标点云分别添加1000个随机噪声点的情况下，其截断误差和其它两个对比算法都较SM-ICP算法增加了两个量级。另一方面，由 图12 图12 可以看出，当噪声点数增多时，SM-ICP的截断误差逐渐增大，而其它对比算法的截断配准误差逐渐减少，其可能是因为Coati配准任务的重叠率始终被设置为90%，导致随着噪声点的增加离群渗入了截断误差的计算中，且噪声点密度的增加使其对应的最近邻点距离逐渐减少。因此，本文所提出SM-ICP算法不仅在具有随机噪声点的配准实验中具有良好的鲁棒性，且其配准精度较其它对比算法更优。最后，虽然SM-ICP算法的配准效率稍差于其它对比算法，但是其在下采样点为11 -4 3.66×10 -4 4.3　发动机叶片点云配准实验 2 在4.1节和在4.2节中的点云配准实验中，本文提出的SM-ICP算法虽然总体上较对比的算法具有更小的配准误差，但是在重叠率较高的配准实验中，Robust Tr-ICP同样也实现了良好的配准结果且具有更好的配准效率。为了进一步验证SM-ICP算法的泛化性，本文设计了重叠率约为90%的发动机叶片点云配准实验，其初始位姿如 图13 图13 所示。该点云数据 ［ 21 21 ］ 由CIMCORE公司的高精度测量系统INFINITE测量得到。明显可以看出，发动机叶片点云的几何特征极为相似且不明显，使得该点云配准容易出现过拟合的结果。针对该配准任务，本文结合四种配准算法分别测试了发动机叶片源点云（酒红色）向目标点云（青色）的配准实验。 由 图14 图14 可知，本文提出的SM-ICP算法依然保持了良好的配准精度，而Robust Tr-ICP算法和S-ICP算法都出现了不同程度的错位。此外，本文还截取了SM-ICP算法与ICP算法配准结果中的局部仰视图，可以看出SM-ICP算法所得配准结果同样较ICP算法更精确，如 图15 图15 所示。因此，本文所提出的SM-ICP算法在几何特征不明显的发动机点云案例，较其它对比算法更具泛化性。 5 结　论 1 本文根据三维点云模型重构精度高、鲁棒性强的要求，提出了SM-ICP点云配准方法，并构建了更具泛化性的混合稀疏点云配准函数。然后，研究了该配准函数涉及的交替乘子法优化框架和正则化损失函数的求解方法。最后，通过双循环的点云配准架构，对离群值进行惩罚，并实现了点云精确配准。实验结果证明：本文算法在重叠率约为50%~90%的斯坦福兔子和发动机叶片点云的配准实验中100%成功的实现了点云精确配准，全部配准案例中的配准误差小于或等于2.041.93×10
